Firstly, evaluate how much each issue affects the model's performance ,issues which are causing significant degradation should be prioritized .As addressing issues with the highest impact can lead to significant improvements in model performance, offering the greatest return on investment in terms of time and resources spent on fixing the issue.

Data. Always the data. Back in 2018 when I started working on AI, the "model" mattered a lot, and so did a lot of other things. Fast forward to 2024, the models are already VERY mature. There are two key things YOU need to do well: 1. The workflow. 2. The data. GIGO (garbage in, garbage out) is the shortest way to put it. If you feed bad data, no matter how smart the AI is, you will get bad outputs. The onus is completely on you.

Once you set issue priorities, it’s crucial to understand your hardware’s capabilities. For example, 4090 and 4090Ti may be similar, but differ in memory size. Once you have such metrics, you may figure out that some of the lost performances can be recovered through trade-off with memory. Such as by increasing batch size.

For computer vision, visualizing the images has proven to me several times to be essential. For dataframes, show the head of the table. Check for outliers, data leakage, overfitting, handling of missing values.

Model optimization involves many steps such as hyperparameter tuning, architecture tweaking , re-train the model using recently collected data to avoid data drift(If present). Try to improve the inference time by removing unwanted layers in the model. Optimizing the model can be the hardest part, as it often requires minor tweaks to the complex model architecture. Use your logs to test your changes with smaller dataset for a few epochs. As the beginning phase of learning is most important, this is often sufficient. In order to fine-tune differences near the end of training, save your checkpoints as they can surprisingly be reused in multiple tests.

After implementing fixes, it’s crucial to validate them to ensure they have resolved the issues without introducing new ones. Use a combination of testing methods, including cross-validation and performance benchmarking, to verify the improvements. Validation helps confirm that the model’s performance has genuinely improved.

If you have done a thorough job with logging, validation should not be an issue. Simply make sure your logs are as per expected. However, through holistic review of the results, you may find that the changes made impacted the model in an unexpected way. Be wary of such trade-offs during validation.

The top two performance issues that arise with AI are 1) accuracy and 2) latency. Latency without accuracy is useless - you're just getting garbage quickly, so let's talk about accuracy. There are three main ways that you can address accuracy of an AI model 1) prompt engineering 2) RAG optimization (arguably part of prompt engineering) 3) fine tuning. Prompt engineering is a lower lift way to solve the problem so start there. If that doesnt work then consider changing/fine tuning/building small language models.

I would start with defining "performance" as it is slightly ambiguous here... Course of actions would be a bit different depending on what kind of performance issues we're trying to tackle (e.g. fixing latency issues is not the same as improving accuracy)
